<b>Why there are two measured lines.</b> The pink line divides GD's loss drop at step t by the average loss drop of a
<i>single</i> mini-batch step taken from the same weights — that is exactly the quantity 1 + Bnoise/B predicts, so it should
sit on the dashed line. The grey line actually runs SGD from those weights until the loss has fallen that far and counts the steps.
It lands slightly higher, because inside the catch-up window the gradient keeps shrinking, so step 2 of the window buys a little
less than step 1 did — a compounding effect the single-step ratio does not include.

<h2>Varying batch size per step: Bt ∈ {Ba, Bb} at random</h2>
<p>Now the batch size itself is a <b>schedule</b> that varies each step. At every learning
step we flip a fair coin and pick one of two sizes, e.g. Bt = 8 or 32 (50% each).
The paper's per-step optimum holds <i>conditionally</i> on the realized Bt:
ε*(Bt) = |G|²/(GTHG + tr(HΣ)/Bt) and the predicted exchange
rate at step t is <b>S(t) = 1 + Bnoise(t)/Bt</b> — a random jittered sequence.
Averaging over the coin gives E[S] = 1 + Bnoise·E[1/B] = 1 + Bnoise·(1/Ba+1/Bb)/2.
Note E[1/B] ≠ 1/E[B]; using the arithmetic mean batch B̄ under-predicts the mean cost.</p>

<b>Derivation.</b> Starting from Eq 2.5–2.8: ΔLopt(B)=−½|G|⁴/(GTHG+tr(HΣ)/B).
Divide full-batch ΔL<sub>GD</sub>=−½|G|⁴/G<sup>T</sup>HG by ΔL<sub>opt</sub>(B<sub>t</sub>) to get S(t)=1+B<sub>noise</sub>/B<sub>t</sub>.
With a schedule the denominator changes each step, so S(t) inherits the schedule's randomness. Its mean over the coin is 1+Bnoise·E[1/B], not 1+Bnoise/E[B]; e.g. for {8,32}, E[1/B]=(1/8+1/32)/2=0.0781 while 1/E[B]=1/20=0.05, a 56% gap. The schedule also affects the *real* SGD trajectory: a small-B step uses a smaller ε*, so progress stalls on tiny-batch steps and surges on large-batch steps — the pink measured line tracks this conditional expectation.

<p class="foot">
Setup: 256 training examples, 12 parameters, linear model with squared error. Feature variances span a factor of 200, so the curvature is ill-conditioned and full-batch GD needs tens of distinct steps rather than a handful. Curvature H is constant, so the second-order prediction is not an approximation — it is exact. Gradient G, curvature H, and the full D×D gradient covariance Σ are computed over all 256 examples at each step, and Bnoise = tr(HΣ) / GTHG is formed from that explicit Σ — no shortcut. Step size is chosen at each step to give the biggest expected drop (Eq 2.6); for full-batch that is the exact line-search minimiser, so no stability cap is needed. Both methods start from the same weights. Mini-batches are drawn <i>with</i> replacement, which is the sampling assumption behind Σ/B in the paper. Median noise scale is the middle value of Bnoise over the first 30 steps.

From the exact weights w_t that GD is at, take ONE mini-batch step with the optimal
eps*(B) and record the real change in full training loss. Average over many batches.
steps = deltaL_GD(t) / mean deltaL_SGD(t).
This is the quantity the paper predicts: it should equal 1 + B_noise/B.
(b) STEPS ACTUALLY NEEDED TO CATCH UP.
From the same w_t, run mini-batch SGD until the full training loss has fallen to
L_GD(t+1) - i.e. until it has banked the same loss delta - and count the steps.
This runs a little higher than (a): within the catch-up window the gradient is
shrinking, so the later steps in the window buy less than the first one did. */
